    Abstract

    Prediction of intermittent chaos is an important issue when detecting the precursors of extreme events such as catastrophic phenomena. We numerically investigate the time-series prediction of intermittent chaos to detect and predict the occurrence of extreme events in a semiconductor laser using reservoir computing (RC). Intermittent chaos is observed in a semiconductor laser subjected to optical self-feedback, and irregular switching occurs suddenly between burst and laminar states. We perform k-step-ahead prediction and investigate the possibilities for the prediction of the occurrence of chaotic bursts using RC.

    Photonic computing is widely used to accelerate the computational performance in machine learning. Photonic decision making is a promising approach utilizing photonic computing technologies to solve the multi-armed bandit problems based on reinforcement learning. Photonic decision making using chaotic mode-competition dynamics has been proposed. However, the experimental conditions for achieving a superior decision-making performance have not yet been established. Herein, we experimentally investigate mode-competition dynamics in a chaotic multimode semiconductor laser in the presence of optical feedback and injection. We control the chaotic mode-competition dynamics via optical injection and observe that positive wavelength detuning results in an efficient mode concentration to one of the longitudinal modes with a small optical injection power. We experimentally investigate two-dimensional bifurcation diagram of the total intensity of the laser dynamics. Complex mixed dynamics are observed in the presence of optical feedback and injection. We experimentally conduct decision making to solve the bandit problem using chaotic mode-competition dynamics. A fast mode-concentration property is observed at positive wavelength detunings, resulting in fast convergence of the correct decision rate. Our findings could be useful in accelerating the decision-making performance in adaptive optical networks using reinforcement learning.

    Photonic accelerators have attracted increasing attention for use in artificial intelligence applications. The multi-armed bandit problem is a fundamental problem of decision making using reinforcement learning. However, to the best of our knowledge, the scalability of photonic decision making has not yet been demonstrated in experiments because of the technical difficulties in the physical realization. We propose a parallel photonic decision-making system to solve large-scale multi-armed bandit problems using optical spatiotemporal chaos. We solved a 512-armed bandit problem online, which is larger than those in previous experiments by two orders of magnitude. The scaling property for correct decision making is examined as a function of the number of slot machines, evaluated as an exponent of 0.86. This exponent is smaller than that in previous studies, indicating the superiority of the proposed parallel principle. This experimental demonstration facilitates photonic decision making to solve large-scale multi-armed bandit problems for future photonic accelerators.

  • Controlling chaotic itinerancy in laser dynamics for reinforcement learning

    Photonic artificial intelligence has attracted considerable interest in accelerating machine learning; however, the unique optical properties have not been fully used for achieving higher-order functionalities. Chaotic itinerancy, with its spontaneous transient dynamics among multiple quasi-attractors, can be used to realize brain-like functionalities. In this study, we numerically and experimentally investigate a method for controlling the chaotic itinerancy in a multimode semiconductor laser to solve a machine learning task, namely, the multiarmed bandit problem, which is fundamental to reinforcement learning. The proposed method uses chaotic itinerant motion in mode competition dynamics controlled via optical injection. We found that the exploration mechanism is completely different from a conventional searching algorithm and is highly scalable, outperforming the conventional approaches for large-scale bandit problems. This study paves the way to use chaotic itinerancy for effectively solving complex machine learning tasks as photonic hardware accelerators.

  • Universal Single-Mode Lasing in Fully Chaotic Billiard Lasers

    By numerical simulations and experiments of fully chaotic billiard lasers, we show that single-mode lasing states are stable, whereas multi-mode lasing states are unstable when the size of the billiard is much larger than the wavelength and the external pumping power is sufficiently large. On the other hand, for integrable billiard lasers, it is shown that multi-mode lasing states are stable, whereas single-mode lasing states are unstable. These phenomena arise from the combination of two different nonlinear effects of mode-interaction due to the active lasing medium and deformation of the billiard shape. Investigations of billiard lasers with various shapes revealed that single-mode lasing is a universal phenomenon for fully chaotic billiard lasers.

    Abstract

    Accelerating artificial intelligence by photonics is an active field of study aiming to exploit the unique properties of photons. Reinforcement learning is an important branch of machine learning, and photonic decision-making principles have been demonstrated with respect to the multi-armed bandit problems. However, reinforcement learning could involve a massive number of states, unlike previously demonstrated bandit problems where the number of states is only one. Q-learning is a well-known approach in reinforcement learning that can deal with many states. The architecture of Q-learning, however, does not fit well photonic implementations due to its separation of update rule and the action selection. In this study, we organize a new architecture for multi-state reinforcement learning as a parallel array of bandit problems in order to benefit from photonic decision-makers, which we call parallel bandit architecture for reinforcement learning or PBRL in short. Taking a cart-pole balancing problem as an instance, we demonstrate that PBRL adapts to the environment in fewer time steps than Q-learning. Furthermore, PBRL yields faster adaptation when operated with a chaotic laser time series than the case with uniformly distributed pseudorandom numbers where the autocorrelation inherent in the laser chaos provides a positive effect. We also find that the variety of states that the system undergoes during the learning phase exhibits completely different properties between PBRL and Q-learning. The insights obtained through the present study are also beneficial for existing computing platforms, not just photonic realizations, in accelerating performances by the PBRL algorithms and correlated random sequences.

  • Photonic reinforcement learning based on optoelectronic reservoir computing

    AbstractReinforcement learning has been intensively investigated and developed in artificial intelligence in the absence of training data, such as autonomous driving vehicles, robot control, internet advertising, and elastic optical networks. However, the computational cost of reinforcement learning with deep neural networks is extremely high and reducing the learning cost is a challenging issue. We propose a photonic on-line implementation of reinforcement learning using optoelectronic delay-based reservoir computing, both experimentally and numerically. In the proposed scheme, we accelerate reinforcement learning at a rate of several megahertz because there is no required learning process for the internal connection weights in reservoir computing. We perform two benchmark tasks, CartPole-v0 and MountanCar-v0 tasks, to evaluate the proposed scheme. Our results represent the first hardware implementation of reinforcement learning based on photonic reservoir computing and pave the way for fast and efficient reinforcement learning as a novel photonic accelerator.

    This study investigates high-entropy chaos generation using a semiconductor laser subject to intensity-modulated optical injection for certified physical random number generation. Chaos with a continuous spectral profile that is not only widely distributed but also broadly flattened over a bandwidth of 33 GHz is generated. The former suggests that the chaos can be sampled at a high rate while keeping sufficient un-correlation between data samples, and the latter indicates that the chaos possesses high entropy, both of which enhance the generation rate of physical random numbers with guaranteed unpredictability. A minimum entropy value of 2.19 bits/sample is obtained without any post-processing and by excluding the contribution from measurement noise, suggesting that, to the least extent, the chaotic source can be used as a 2-bit physical random number generator at a rate of 160 Gbits/s.

  • Entropy rate of chaos in an optically injected semiconductor laser for physical random number generation

    We evaluate the (ε, τ) entropy of chaotic laser outputs generated by an optically injected semiconductor laser for physical random number generation. The vertical resolution ε and sampling time τ are numerically optimized by comparing the (ε, τ) entropy with the Kolmogorov–Sinai entropy, which is estimated from the Lyapunov exponents using linearized model equations. We then investigate the dependence of the (ε, τ) entropy on the optical injection strength of the laser system. In addition, we evaluate the (ε, τ) entropy from the experimentally obtained chaotic temporal waveforms in an optically injected semiconductor laser. Random bits with an entropy close to one bit per sampling point are extracted to satisfy the conditions of physical random number generation. We find that the extraction of the third-most significant bit from eight-bit experimental chaotic data results in an entropy of one bit per sample for certified physical random number generation.

    The techniques for performance improvement of delay-based reservoir computing with photonic systems are proposed and summarized. A chaos input mask signal is introduced to improve the performance of a time-series prediction task. A photonic integrated circuit is used to miniaturize the reservoir computing system. The performance of reservoir computing is compared between a single electro-optic system and a mutually coupled electro-optic system.

  • Using multidimensional speckle dynamics for high-speed, large-scale, parallel photonic computing

    The recent rapid increase in demand for data processing has resulted in the need for novel machine learning concepts and hardware. Physical reservoir computing and an extreme learning machine are novel computing paradigms based on physical systems themselves, where the high dimensionality and nonlinearity play a crucial role in the information processing. Herein, we propose the use of multidimensional speckle dynamics in multimode fibers for information processing, where input information is mapped into the space, frequency, and time domains by an optical phase modulation technique. The speckle-based mapping of the input information is high-dimensional and nonlinear and can be realized at the speed of light; thus, nonlinear time-dependent information processing can successfully be achieved at fast rates when applying a reservoir-computing-like-approach. As a proof-of-concept, we experimentally demonstrate chaotic time-series prediction at input rates of 12.5 Gigasamples per second. Moreover, we show that owing to the passivity of multimode fibers, multiple tasks can be simultaneously processed within a single system, i.e., multitasking. These results offer a novel approach toward realizing parallel, high-speed, and large-scale photonic computing.   • Entropy evaluation of white chaos generated by optical heterodyne for certifying physical random number generators

    The entropy of white chaos is evaluated to certify physical random number generators. White chaos is generated from the electric subtraction of two optical heterodyne signals of two chaotic outputs in semiconductor lasers with optical feedback. We use the statistical test suites of NIST Special Publication 800-90B for the evaluation of physical entropy sources of white chaos with an eight-bit resolution. The minimum value of entropy is 2.1 for eight most significant bits data. The entropy of white chaos is enhanced from that of the chaotic output of the semiconductor lasers. We evaluate the effect of detection noise and distinguish between the entropy that originates from the white chaos and the detection noise. It is found that the entropy of five most significant bits originates from white chaos.     We investigate the instantaneous behavior of synchronized temporal wave forms in two mutually coupled semiconductor lasers numerically and experimentally. The temporal wave forms of two lasers are synchronized with a propagation delay time, with one laser oscillating in advance of the other, known as the leader-laggard relationship. The leader-laggard relationship can be determined by measuring the cross-correlation between the two temporal wave forms with the propagation delay time. The leader can be identified when the optical carrier frequency of the leader laser is higher than that of the other laser. However, spontaneous exchange between the leader and laggard lasers can be observed in low-frequency fluctuations by short-term cross-correlation measurements, even for a fixed initial optical frequency detuning. The spontaneous exchange of the leader-laggard relationship originates from alternation of partial optical frequency locking between the two lasers. This observation is analyzed using a phase space trajectory on steady-state solutions for mutually coupled lasers with optical frequency detuning.

    Reservoir computing (RC) is a machine learning paradigm based on information processing in the human brain. Recently, RC based on a semiconductor laser with time-delayed optical feedback has been proposed. In this scheme, fast transient response (a fast relaxation time) of the laser is necessary for fast information processing. By using numerical and linear stability analysis, in this study, we show that a semiconductor laser with strong optical injection can produce fast transient response. We also numer-

    We experimentally investigate an intermittent route to chaos in a photonic integrated circuit consisting of a semiconductor laser with time-delayed optical feedback from a short external cavity. The transition from a period-doubling dynamics to a fully-developed chaos reveals a stage intermittently exhibiting these two dynamics. We unveil the bifurcation mechanism underlying this route to chaos by using the Lang-Kobayashi model and demonstrate that the process is based on a phenomenon of attractor expansion initiated by a particular distribution of the local Lyapunov exponents. We emphasize on the crucial importance of the distribution of the steady-state solutions introduced by the time-delayed feedback on the existence of this intermittent dynamics.     We applied complex linear minimum mean-squared-error equalization to spatially quadrature-amplitude-modulated signals in holographic data storage (HDS). The equalization technique can improve dispersion in constellation outputs due to intersymbol interference. We confirm the effectiveness of the equalization technique in numerical simulations and basic optical experiments. Our numerical results have shown that intersymbol interference of a retrieved signal in a HDS system can be improved by using the equalization technique. In our experiments, a mean squared error (MSE), which indicates the deviation from an ideal signal, has been used for quantitatively evaluating the dispersion of equalized signals. Our equalization technique has been able to improve the MSE. However, symbols in the equalized signal have remained inseparable. To further improve the MSE and make the symbols separable, reducing errors in repeated measurements is our future task. (C) 2016 The Japan Society of Applied Physics

    Reservoir computing is a machine-learning paradigm based on information processing in the human brain. We numerically demonstrate reservoir computing with a slowly modulated mask signal for preprocessing by using a mutually coupled optoelectronic system. The performance of our system is quantitatively evaluated by a chaotic time series prediction task. Our system can produce comparable performance with reservoir computing with a single feedback system and a fast modulated mask signal. We showed that it is possible to slow down the modulation speed of the mask signal by using the mutually coupled system in reservoir computing. (C) 2016 The Japan Society of Applied Physics

We introduce a chaos mask signal as an input temporal mask for reservoir computing and perform a time-series prediction task. We compare the errors of the task obtained from the chaos mask signal with those obtained from other digital and analog masks.     We numerically investigate the frequency bandwidth and the autocorrelation characteristics of chaotic temporal wave forms in unidirectionally coupled semiconductor lasers with time-delayed optical feedback. We evaluate the complexity of the chaotic temporal wave forms by using Lyapunov exponents. We found that larger maximum Lyapunov exponents can be obtained for smaller peak values of the autocorrelation function at the delay time of the optical feedback. On the contrary, the maximum Lyapunov exponent is independent from the frequency bandwidth of the chaotic temporal wave forms.

    We report experimentally on the bifurcation cascade leading to the appearance of self-pulsation in a photonic integrated circuit in which a laser diode is subjected to delayed optical feedback. We study the evolution of the self-pulsing frequency with the increase of both the feedback strength and the injection current. Experimental observations show good qualitative accordance with numerical results carried out with the Lang-Kobayashi rate equation model. We explain the mechanism underlying the self-pulsations by a phenomenon of beating between successive pairs of external cavity modes and antimodes.

    We report information processing by using mutually-coupled optoelectronic system, which is called reservoir computing. Reservoir computing is a novel bio-inspired computing method and highly efficient approach for processing empirical data. We numerically show that the performance of reservoir computing is improved by using two Mach-Zehnder modulators. Chaotic time-series prediction task is used for evaluation of the performance. Our result shows that the reservoir using the two modulators has better performance than using a single one.

    We experimentally demonstrate fast physical random bit generation from bandwidth-enhanced chaos by using three-cascaded semiconductor lasers. The bandwidth-enhanced chaos is obtained with the standard bandwidth of 35.2 GHz, the effective bandwidth of 26.0 GHz and the flatness of 5.6 dB, whose waveform is used for random bit generation. Two schemes of single-bit and multi-bit extraction methods for random bit generation are carried out to evaluate the entropy rate and the maximum random bit generation rate. For single-bit generation, the generation rate at 20 Gb/s is obtained for physical random bit sequences.     dynamical systems. We apply the method to the Mackey-Glass model with time-delayed feedback. We investigate the standard deviation of the probability distribution of the finite-time Lyapunov exponents when the finite time or the delay time is changed. It is found that the standard deviation decreases in a power-law scaling with the exponent similar to 0.5 as the finite time or the delay time is increased. Similar results are obtained for the finite-time Lyapunov spectrum.

    Consistency of response in a system driven repeatedly by a complex signal has been observed in many nonlinear dynamical systems. We investigate the consistency of unidirectionally coupled semiconductor lasers with optical feedback and measure the complexity of the entire laser system by using the Lyapunov spectrum. The complexity strongly depends on the degree of consistency. It is found that the complexity of the coupled laser system can be classified into three regions. When the system shows consistency, the complexity of the entire laser system corresponds to that of the solitary drive laser. In the inconsistency region, the complexity of the entire laser system corresponds to the sum of the complexity of the uncoupled drive and response lasers. The complexity increases more than the sum of the two solitary lasers near the boundary of the consistency region, where new dynamical fluctuations appear due to the optical carrier interaction between the two lasers.

    We investigate generalized synchronization and complexity in unidirectionally coupled Rössler systems and Mackey-Glass systems with time-delayed feedback. The generalized synchronization is measured by using two identical response systems which are driven by a common drive system. To measure the complexity, KS entropy and KY dimension are calculated quantitatively from the Lyapunov spectrum by using the linearized equations. The response systems show generalized synchronization for large coupling strengths. The entropy and dimensionality decrease as the coupling strength is increased. The minimum value of entropy is obtained at the condition of generalized synchronization, whose value corresponds to the entropy for the solitary drive system, even though the temporal waveforms of the drive and response systems are significantly different. The maximum entropy is achieved outside the region where generalized synchronization is achieved, whose value almost corresponds to the sum of those of the two solitary drive and response systems. It is found that the coupling effect changes the entropy within these two values. The dimensionality decreases monotonically even within the region of generalized synchronization.

    We analyze the time for growth of bit entropy when generating nondeterministic bits using a chaotic semiconductor laser model. The mechanism for generating nondeterministic bits is modeled as a 1-bit sampling of the intensity of light output. Microscopic noise results in an ensemble of trajectories whose bit entropy increases with time. The time for the growth of bit entropy, called the memory time, depends on both noise strength and laser dynamics. It is shown that the average memory time decreases logarithmically with increase in noise strength. It is argued that the ratio of change in average memory time with change in logarithm of noise strength can be used to estimate the intrinsic dynamical entropy rate for this method of random bit generation. It is also shown that in this model the entropy rate corresponds to the maximum Lyapunov exponent.

    Many nonlinear dynamical systems show the consistent behavior when they are driven repeatedly with a complex signal, which is called consistency. Application of consistency to physical one-way function has been expected. In this work, we investigate the consistency of coupled semiconductor lasers with optical feedback and measure the complexity of the coupled laser system by using Lyapunov spectrum. It is found that the complexity of coupled lasers decreases suddenly when consistency is achieved.

    We investigate transient dynamics of synchronized low frequency fluctuations (LFFs) in mutually coupled semiconductor lasers. We observe repeated spontaneous switching of leader-laggard relationship in two lasers. We found that the relationship between the optical frequencies of the two lasers decides the leader laser with sudden intensity dropouts of LFFs. We explain this phenomenon by using an analysis of steady state solutions in the Lang-Kobayashi equations that describe the dynamics of semiconductor lasers. We found that the optical frequency of the leader laser attracts the optical frequency of the laggard laser while the trajectories of the two lasers wander many steady state solutions, and spontaneouts switching of leader-laggard relationship occurs. We also found that sudden intensity dropouts occur at the maximum gain mode obtained from the analysis of steady state solutions in a solitary laser with optical feedback.

    We investigate instantaneous behaviors of the leader-laggard relationship of temporal waveforms in mutually-coupled two semiconductor lasers in the open-loop configuration. The temporal waveform of one laser output is delayed with respect to that of the other laser output by the propagation delay time, and the leader-laggard relationship can be determined by measuring cross correlation between the two temporal waveforms with time delay. The leader can be identified on average when the optical carrier frequency of the leader laser is higher than the other laser. However, when short-term cross-correlation is measured and the local structure of the leader-laggard relationship is investigated, spontaneous exchange between the leader and laggard lasers can be observed in time, even for fixed initial optical frequency detuning. These numerical results agree with our experimental observation.

    Semiconductor lasers with time-delayed optical feedback have infinite dimensionality in general. The methods for estimating Lyapunov exponents have not been established yet. In this study, we propose a method for calculating the maximum Lyapunov exponent in semiconductor lasers with time-delayed optical feedback by using generalized synchronization. The maximum Lyapunov exponent is numerically estimated and compared with the exponent calculated from the linearized Lang-Kobayashi equation. The maximum Lyapunov exponents calculated by using the two methods are almost identical. This method can be applied for the estimation of the maximum Lyapunov exponent in experimental systems.

    Lyapunov exponents represents a exponential expansion (construction) rate of a infinitesimal perturba-tion to an orbit of a dynamical system, which are asymptotic values over an attractor of the system. Finite-time Lyapunov exponents have been proposed to quantify the exponential expansion (construction) rate for finite orbits. We can obtain some information which is useful for classification of chaos dynamics, chaos control, and prediction. However, a method for calculation of the finite-time Lyapunov exponents in time-delayed dynamical systems have not been well established yet because of the difficulty of calculating Lyapunov exponents in time-delayed high-dimen-sional systems. We present a method for calculating the finite-time Lyapunov exponents in time-delayed dynamical systems, and apply it to a Mackey-Glass model, an optpelectromc feedback laser system and a Lang-Kobayashi equation for a semiconductor laser with optical feedback. We investigate standard deviation of the finite-time Lya-punov exponents for the variation of a delay time and a length of a orbit. It is found that the standard deviation approaches to zero as finite time L, and this approach is as L-v.

    Local Lyapunov exponents can be used to evaluate local stability of dynamical systems in phase space. In time-delayed dynamical systems, the techniques for calculating local Lyapunov exponents have not been well established, even though some examples of the calculation of the averaged Lyapunov exponent have been reported. We propose a method to calculate local Lyapunov exponents in time-delayed dynamical systems and evaluate the validity of the method by using a model of a semiconductor laser with time-delayed optical feedback.

    Consistency of response in a system driven repeatedly by a complex signal has been observed in many nonlinear dynamical systems. Consistency could be applied for physical one-way function for information security. We investigate the consistency of coupled semiconductor lasers with optical feedback and measure the complexity of the coupled laser system by using Lyapunov spectrum. The complexity of coupled lasers increases with the increase of a coupling strength, however, the complexity decreases suddenly when consistency is achieved under strong coupling strength.

    非線形ダイナミクスを用いた情報処理手法として,リザーバコンピューティングに注目が集まっている.リザーバコンピューティングは脳を模した情報処理手法であり,時系列予測や音声認識などの処理が可能である.リザーバコンピューティングに用いられる非線形ダイナミカルシステムとして,従来はリカレントネットワークが用いられていたが,時間遅延ダイナミカルシステムを用いた手法が近年提案されている.本講演では,時間遅延ダイナミカルシステムを用いたリザーバコンピューティングの実装方法について概説する.
